How to come up with the data cleansing strategy to make sure the data is
reliable and accurate and free of errors. Did anyone work on it before?

In classic client it is possible to test the database. File, Database, Test.
reliable and accurate and free of errors.
This mostly depends on the users that have put in the data.
What kind of data do you mean?

That's only going to check a few things such as the physical integrity of database records and keys. Plus foreign key relations that are defined. It's not going to do any for of financial validation. So if you deleted open records or something, it won't find those.
Use the various financial reports to reconcile. Run them before and after your process. They should still balance. Better yet, don't delete to begin with. There are no bugs - only undocumented features.0
